IndexCache, a new sparse attention optimizer, delivers 1.82x faster inference on long-context AI models

The article discusses the development and implementation of IndexCache, a new sparse attention optimizer that enhances the efficiency of long-context AI models. Researchers from Tsinghua University and Z.ai created IndexCache to address the computational inefficiencies associated with processing large quantities of tokens in language models. The technique has been shown to deliver significant performance improvements, achieving up to 1.82 times faster time-to-first-token and 1.48 times faster generation throughput for models that utilize the DeepSeek Sparse Attention architecture.

IndexCache effectively reduces redundant computations by caching important tokens across model layers, which minimizes computational complexity from quadratic to linear. This approach allows models to maintain high output quality while speeding up processing times. The research highlights that adjacent transformer layers often share a significant number of selected tokens, which IndexCache leverages to optimize performance.

For practical application, two deployment methods for IndexCache were developed. The first method is training-free and utilizes a “greedy layer selection” algorithm to optimize layer configurations without requiring weight updates. The second method is training-aware and focuses on pre-training or fine-tuning models to support cross-layer sharing more effectively. Initial tests on a 30-billion-parameter model demonstrated a reduction in prefill latency from 19.5 seconds to 10.7 seconds, alongside an increase in throughput during the decoding phase.

The researchers emphasize that these improvements translate to cost savings for enterprises, especially in scenarios that demand long-context processing, such as document analysis and agentic workflows. The deployment of IndexCache is designed to be accessible, with open-source patches available for integration into existing inference systems. The findings suggest a potential shift in the AI industry’s focus toward designing models with real-world throughput and latency considerations from the outset.

Overall, IndexCache is positioned as a significant advancement in optimizing AI model performance, particularly for applications requiring extensive context processing.
